Abstract

The increasing use of data-driven technologies has created significant opportunities for intelligent computing, predictive analytics, and automated decision-making. However, conventional machine learning approaches often require centralized data collection, which can introduce privacy risks, security vulnerabilities, and regulatory challenges. Federated learning has emerged as an alternative approach that enables multiple devices or organizations to collaboratively train machine learning models without routinely transferring their raw training data to a central server. Instead, participating clients perform local training and communicate model updates to a coordinating server or aggregation mechanism. This approach can reduce direct data sharing and support collaborative learning across distributed environments. This paper presents a review of federated learning, focusing on its fundamental architecture, training process, aggregation techniques, applications, and technical limitations. It examines the role of federated learning in healthcare, financial services, mobile computing, industrial systems, and smart environments. The paper also discusses challenges involving communication overhead, statistical heterogeneity, device limitations, malicious participants, privacy leakage, and model convergence. Furthermore, it explores complementary techniques, including differential privacy, secure aggregation, and homomorphic encryption, that can strengthen the protection of information during collaborative training. Finally, future research directions are identified in adaptive aggregation, communication-efficient optimization, cross-silo collaboration, edge intelligence, and trustworthy model evaluation. The review concludes that federated learning offers a promising framework for distributed machine learning, but its privacy and performance benefits depend on the system architecture, threat model, data distribution, and security mechanisms employed.
